Dev Engineer Review

The change routes DSparkMiniMaxDraftModel to the DSpark implementation and flattens its configuration for loading. It adds MiniMax checkpoint-name remapping, MXFP8 dequantization, and Gemma norm folding. GQA DSpark windowed layers now use non-causal attention by default; explicit causality metadata preserves causal behavior. TRTLLM lowering supports finite non-causal windows through causal decode and future-block attention merging. The change also updates context-lowering detection and adds the architecture to the public architecture allowlist.

The PR description reports a known limitation: prompts of about 131k tokens or more can fail with Draft KV cache context resize failed when block reuse is disabled or when using a disaggregated generation server. Review findings and severity counts are unavailable. Test execution and overall completion status are not established.

QA Engineer Review

The tests add MiniMax config-routing and weight-preparation coverage, update DFlash lowering semantics, and add DSpark non-causal window tests. Coverage includes CPU oracle comparisons, explicit causality metadata, TRTLLM windowed attention, long contexts, and CUDA Graph replay. The B200 CI list includes test_dspark_noncausal_window.py; no CI or manual-QA list entry was found for the MiniMax or DFlash semantics tests. The MiniMax tests do not establish end-to-end checkpoint loading or generation. Coverage verdict: needs follow-up. Test execution results are unavailable.

Per-File QA Perspective

  • tensorrt_llm/_torch/models/_arch_index.py: Registers DSparkMiniMaxDraftModel to resolve to modeling_dspark. Verify architecture discovery selects the intended model.
  • tensorrt_llm/_torch/models/modeling_dspark.py: Adds MiniMax model construction and checkpoint conversion, and changes default causality for GQA DSpark windowed layers. Verify config construction, weight loading, explicit causal metadata, and generation.
  • tensorrt_llm/_torch/pyexecutor/config_utils.py: Adds MiniMax config flattening and architecture-specific loading. Verify nested-field precedence, dtype selection, and sliding-window translation.
  • tensorrt_llm/_torch/models/modeling_dflash.py: Adds TRTLLM lowering for non-causal finite windows using future-block attention merging. Verify output correctness at window and cache boundaries and across supported backends.
  • tensorrt_llm/_torch/speculative/dflash.py: Uses the returned lowering modes to detect context attention. Verify runtime validation handles each lowering mode correctly.
  • tensorrt_llm/_torch/speculative/dflash_attention.py: Adds the DFLASH_CONTEXT_LOWERING identifier used by runtime validation. Verify this value stays consistent with the lowering returned by the model.
  • tensorrt_llm/usage/architecture_allowlist.py: Adds the MiniMax architecture to the public telemetry allowlist. Verify architecture reporting accepts the identifier.
  • docs/source/models/supported-models.md: Documents MiniMax DSpark support and the long-prompt limitation. Verify the documented checkpoint and config details match the loader.
  • tests/unittest/_torch/speculative/hw_agnostic/test_minimax_dspark_draft.py: Covers config flattening and routing, registration, remapping, dequantization, quantized-config rejection, and norm folding. No CI or manual-QA list entry was found.
  • tests/unittest/_torch/speculative/hw_agnostic/test_dflash2_semantics.py: Adds checks for non-causal window behavior, explicit causality, and TRTLLM lowering. No CI or manual-QA list entry was found.
  • tests/unittest/_torch/speculative/hw_agnostic/test_dspark_noncausal_window.py: Covers attention-oracle comparisons, window resolution, TRTLLM windowed attention, long contexts, and CUDA Graph replay. The file is listed in tests/integration/test_lists/test-db/l0_b200.yml; no manual-QA list entry was found.
  • tests/integration/test_lists/test-db/l0_b200.yml: Adds test_dspark_noncausal_window.py to the B200 CI list. Its comment notes that the TRTLLM case skips on GPUs other than SM100/SM103.

Description

MiniMax-M3.1-Flash ships a standalone DSpark drafter in its dspark/ directory (architecture DSparkMiniMaxDraftModel, 5 GQA layers with 4096-token sliding attention, MXFP8 weights). This change lets speculative_config: {decoding_type: DSpark, speculative_model: <checkpoint>/dspark} load and run it on the existing GQA DSpark path.

  • config_utils.py: the drafter's config.json is VL-shaped (model_type: minimax_m3_vl, backbone under text_config, no auto_map), so load_pretrained_config routes it by architecture to build_minimax_dspark_draft_config, which flattens it into a plain PretrainedConfig, drops the quantization block (the weights are dequantized at load) and maps the HF sliding_attention + sliding_window spelling to the DFlash use_swa / swa_window_size keys.
  • modeling_dspark.py: MiniMaxDSparkBackbone is the registry entry for DSparkMiniMaxDraftModel (GQA attention with per-head Q/K norm and partial NeoX RoPE, dense swiglu-oai MLP). _build_dspark_draft picks MiniMaxDSparkForCausalLM, a GQADSparkForCausalLM that renames the checkpoint tensors out of their language_model.model.dspark. namespace, dequantizes the MXFP8 linears to the compute dtype and folds the Gemma (1 + w) norm weights before the DFlash loader sees them.
  • _arch_index.py: lazy-zoo entry for the architecture.
  • modeling_dspark.py / modeling_dflash.py: the drafter was trained with a non-causal block. Each block query attends every block position plus the context keys inside its 4096-token window, but the windowed GQA DSpark layers were forced causal. GQADSparkForCausalLM now declares windowed layers non-causal with a two-sided window. This is a class-wide change for every GQA DSpark drafter whose config carries a sliding_window, not only MiniMax; explicit checkpoint metadata still wins (is_causal: true, or the speculators sliding_window_non_causal: false, keeps the causal windowed decode), and the speculators Kimi K3 conversion drops its window, so no existing checkpoint changes behavior. On the TRTLLM backend dflash_trtllm_windowed_block_attention lowers this exactly: a causal sliding-window decode over the paged cache, returning its log-sum-exp (converted from base 2), merged with the block keys after each query. validate_block_attention_windows logs and returns the lowering per layer instead of rejecting windowed non-causal layers, and the TRTLLM runtime check derives its context-kernel requirement from those lowerings, so a windowed layer is no longer held to the context kernel's head-size limits. On GB300 TP4 with K=7 on SPEED-Bench coding prompts, acceptance length goes from 3.21 to 3.77-3.83 with rejection sampling and from 3.61 to 3.96-4.08 with greedy drafting.

The drafter runs on the existing separate draft KV pool; no runtime or KV cache manager change is part of this PR.

Dependency: loading the MiniMax-M3.1-Flash target itself needs #20847 (NVFP4 MoE packaging); this PR shares no files with it and can merge in either order.

Known limitation, fix to follow in a separate PR: with block reuse disabled, or with DSpark on a disaggregated generation server, the draft KV mirror is sized to the whole prompt and the first prompt of about 131k tokens or more fails with Draft KV cache context resize failed. With block reuse enabled (the default), the drafter and target pools are paired and long prompts serve correctly. This is also documented in the [^21] footnote of the supported-models page.

Follow-up, not in this PR: an accuracy-suite entry for MiniMax-M3.1-Flash + DSpark in tests/integration/defs/accuracy/test_llm_api_pytorch.py, once the target loads on main (#20847).

Test Coverage

  • tests/unittest/_torch/speculative/hw_agnostic/test_minimax_dspark_draft.py (new, cpu_only): config flattening of the shipped drafter config (reduced to the loader fields), the sliding-window key translation, routing by architecture in load_pretrained_config, backbone registration, tensor-name remap, MXFP8 dequantization against a per-block reference (uint8 and float8_e8m0fnu scales, non-byte scales rejected), Gemma norm fold, and the refusal to build the drafter from a quantized draft config.
  • tests/unittest/_torch/speculative/hw_agnostic/test_dspark_noncausal_window.py (new; CPU, plus TRTLLM cases on Blackwell, added to l0_b200.yml): mask semantics of the windowed non-causal block, the explicit-metadata escape hatch, the head-size regression (windowed layers at head_dim 72/80/96 are not rejected by the context-kernel check), the TRTLLM lowering against a dense reference across window, block-size and history-length edges, and CUDA-graph replay. The CPU cases carry cpu_only; the TRTLLM cases run in the l0_b200.yml stage.
  • tests/unittest/_torch/speculative/hw_agnostic/test_dflash2_semantics.py (cpu_only): the TRTLLM backend now lowers windowed non-causal layers instead of rejecting them.
  • CI: L0 pipeline 66667 on 99428dc ran every DGX_B200 and B300 stage green, including test_dspark_noncausal_window.py; the pipeline's red stages were an H100 test-process leak and a CPU-arm disaggregated timing flake, neither in files this PR touches.
  • tests/unittest/others/test_lazy_model_zoo.py covers the _arch_index.py entry.

PR Checklist

  • Please check this after reviewing the above items as appropriate for this PR.

The drafter's VL-shaped config.json is flattened by architecture, with its
sliding-window layers mapped to the DFlash use_swa spelling. Its checkpoint
tensors are renamed out of their namespace, MXFP8-dequantized and Gemma
norm-folded at load, and run on the GQA DSpark block decode.

Walkthrough

The change adds standalone MiniMax DSpark drafter support, including configuration handling, checkpoint conversion, model registration, and dispatch. It also updates TRTLLM DFlash handling for non-causal finite-window attention through causal decode and future-block merging.

Changes

MiniMax DSpark drafter

Layer / File(s) Summary
Flatten drafter configuration
tensorrt_llm/_torch/pyexecutor/config_utils.py, tests/unittest/_torch/speculative/hw_agnostic/test_minimax_dspark_draft.py
The config builder merges nested text_config fields over top-level fields, sets the architecture and dtype, and derives DFlash sliding-window fields under specified conditions. Config loading routes matching architectures to this builder. Tests cover flattening and routing.
Convert MiniMax checkpoint weights
tensorrt_llm/_torch/models/modeling_dspark.py, tests/unittest/_torch/speculative/hw_agnostic/test_minimax_dspark_draft.py
Weight preparation remaps checkpoint names, dequantizes MXFP8 weights using 32-column scale blocks, removes scale tensors, and increments specified Gemma norm weights. Tests cover these conversions.
Register and select the drafter
tensorrt_llm/_torch/models/_arch_index.py, tensorrt_llm/_torch/models/modeling_dspark.py, tensorrt_llm/usage/architecture_allowlist.py, docs/source/models/supported-models.md
Adds MiniMax GQA attention, decoder, backbone, and causal-LM classes. The architecture index registers the backbone, standalone dispatch selects the MiniMax class when the config architecture matches, and the architecture is added to the telemetry allowlist. The supported-models documentation describes the drafter.

Non-causal DFlash window attention

Layer / File(s) Summary
Merge future-block attention
tensorrt_llm/_torch/models/modeling_dflash.py, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_noncausal_window.py
Adds attention merging for eligible future block keys and a TRTLLM decode helper that combines the merge with paged decode. CPU tests compare the merge with a dense attention oracle.
Route attention by window and mask
tensorrt_llm/_torch/models/modeling_dflash.py, tensorrt_llm/_torch/models/modeling_dspark.py, tensorrt_llm/_torch/speculative/dflash.py, tensorrt_llm/_torch/speculative/dflash_attention.py, tests/unittest/_torch/speculative/hw_agnostic/test_dflash2_semantics.py, tests/unittest/_torch/speculative/hw_agnostic/test_dspark_noncausal_window.py, tests/integration/test_lists/test-db/l0_b200.yml
DSpark applies non-causal two-sided window bounds. TRTLLM window validation reports per-layer lowering, and DFlash dispatch uses causal decode with future-block merging for non-causal windowed layers. Tests cover lowering, masks, paged caches, and CUDA Graph replay.

Explanation

The title follows the repository template with a JIRA ticket and [feat] type. It names the primary change: serving MiniMax-M3.1-Flash with its bundled DSpark drafter. The changeset adds the drafter config routing, model classes, weight remapping, and dequantization that support this. It also includes non-causal window changes that the title does not mention, which is expected for a concise title.

Full details: Description check

Explanation

The description follows the template's main sections: Description, Test Coverage, and PR Checklist. The Description explains the drafter loading path, the config and model changes, the non-causal window change, and a known limitation. Test Coverage lists the new and updated test files and the CI status. The PR Checklist has only the final acknowledgement box checked, and the other checklist items are not addressed. The description also does not state the API impact label (api-compatible or api-breaking). The description is mostly complete, so the check passes, but the author should confirm the API label and the checklist items.

Test the checkpoint through the drafter loader.

The tests call prepare_minimax_dspark_weights directly. None constructs MiniMaxDSparkForCausalLM and passes translated tensors through load_weights. A key or tensor-shape mismatch between conversion and the DFlash loader can therefore escape these tests. Add the smallest practical synthetic-checkpoint test that constructs the drafter, loads a complete minimal weight set, and checks one draft step. Put a GPU-dependent case in the applicable integration test location and select its test list if it must run in CI. As per path instructions, “Leave an INLINE review comment on the smallest relevant changed production-code hunk when a material test coverage gap exists.”

DSpark drafters are trained with a non-causal block and a two-sided window,
but DFlash resolved every windowed draft layer as causal. GQA DSpark now
resolves non-causal (W-1, W-1); the TRTLLM backend serves it as the causal
windowed decode plus a log-sum-exp merge of the later block keys.

Add a loader-path regression test for the MiniMax drafter.

The tests in test_minimax_dspark_draft.py cover config routing, the architecture constant, backbone registration, the GQADSparkForCausalLM subclass relationship, and the output of prepare_minimax_dspark_weights. No test builds the drafter through _build_dspark_draft or passes converted tensors through MiniMaxDSparkForCausalLM.load_weights. A checkpoint-key, tensor-shape, or partial-RoPE mismatch in the load path can therefore pass the current tests.

Add a synthetic-checkpoint case to tests/unittest/_torch/speculative/hw_agnostic/test_minimax_dspark_draft.py. Build the drafter from a config with "architectures": ["DSparkMiniMaxDraftModel"], pass a checkpoint in the source tensor naming through load_weights, and run one draft step. The sibling DSpark test in test_kimi_k3_dspark_semantics.py builds through _build_dspark_draft and moves the model to CUDA under @needs_gpu. If the new case needs CUDA, use the same marker.

Add a load-and-decode test for the MiniMax drafter.

The new tests check transformed tensors and the MiniMaxDSparkForCausalLM class relationship. No test calls load_weights or runs a forward pass through the drafter. A split Q/K/V or MLP shape error, or a checkpoint-name mismatch with the backbone parameters, can pass these tests and then fail on the first draft step. Add a small synthetic-checkpoint test that builds the drafter, calls load_weights with split Q/K/V and MLP tensors, and checks one block's output against a small reference. Place it beside test_minimax_dspark_draft.py if its execution requirements fit that suite. (raw.githubusercontent.com)

The non-causal-window lowering is the part that carries the risk, and only the SM100 test (test_trtllm_windowed_non_causal_matches_the_oracle, long-context, CUDA-graph) actually checks the kernel's LSE base and window semantics; the CPU tests prove the merge given a correct LSE. Please state in the description that the B200 run passed (or paste the /bot run result) before merge.

A few whole-PR items:

  • Scope of the mask change. GQADSparkForCausalLM._get_attention_mask_args now forces non-causal two-sided windows for every GQA DSpark drafter with a sliding_window, not just MiniMax. The speculators K3 conversion zeroes its window so it is unaffected, but the description frames this as a MiniMax enablement. Please call the class-wide behavior change out explicitly (and see the inline note about explicit is_causal metadata).
  • Ticket. This is a new model/feature with a kernel-level attention change; it should carry a JIRA id in the title rather than [None].
  • Docs. The ≥131k-prompt failure mode (Draft KV cache context resize failed with block reuse disabled or on a disagg generation server) is in the PR description but not in the [^21] footnote or any docs page. Users hitting it will have no pointer. Add it to the footnote or the MiniMax deployment notes.
  • End-to-end coverage. There is no accuracy-suite entry for MiniMax-M3.1-Flash + DSpark (tests/integration/defs/accuracy/test_llm_api_pytorch.py style). If it can't be added now, note that as a follow-up in the description.
  • Stale comment. tensorrt_llm/_torch/speculative/dflash.py:1339 still says "No non-causal sliding window there either" above the call to validate_block_attention_windows(), which no longer rejects that case.
  • CPU stage. test_minimax_dspark_draft.py has no pytest.mark.cpu_only, so the CPU stage's collection filter (tests/unittest/conftest.py:283) skips it; it only runs via the l0_h100.yml directory entry. Adding the marker (as test_dspark_speculators_checkpoint.py does) gets it onto the cheap stage too.

The base-2 claim is consistent with the existing MLA fixup ([modeling_dspark.py:3215](https://github.com/NVIDIA/TensorRT-LLM/pull/20922/files#diff-dbf8b0b20defc616638c747f47762e6259dbd5ee54a151c96f299cf1dc47ab5aR3215) multiplies the trtllm-gen LSE by _LN2), but the flashinfer wrapper docstring does not state it, so the only guard is the SM100 oracle test. Consider reusing _LN2 (or moving it next to this helper) so there is one place to fix if a flashinfer bump changes the convention, and make sure the B200 run of test_dspark_noncausal_window.py is green before merge.

Done: one TRTLLM_GEN_LSE_LN2 in modeling_dflash, used by the merge and the MLA fixup. The B200 and B300 stages of pipeline 66667 were green on the previous head, including test_dspark_noncausal_window.py.

The shared TRTLLM_GEN_LSE_LN2 is in place and the MLA fixup uses it; that part is settled. On the CI evidence: pipeline 66667 ran on the previous head, and 2bd688e changed the lowering caller and the mask override after it. Also, l0_b300.yml lists only test_dspark_v41.py, so the B300 stage did not run test_dspark_noncausal_window.py; only the B200 list has it. A green B200 run on the current head settles this; please trigger the bot and I will resolve.

The runtime capability check still derives has_context_attention from not _get_attention_mask_args(...)[0] in DFlashDrafter._lazy_init_ctx_buffers. A non-causal windowed layer now uses decode plus this merge, but that predicate still marks it as context attention. Drafters with head dimensions 72, 80 or 96 are therefore rejected by UNSUPPORTED_HEAD_SIZES_CONTEXT before allocation even when every layer uses the decode path. Could you derive the context requirement from these returned lowerings and add a regression case for a windowed layer at one of those head sizes? This is required for this PR.

Done: has_context_attention = DFLASH_CONTEXT_LOWERING in lowerings from the returned lowerings, plus a regression test at head_dim 72/80/96 (windowed layers pass, unwindowed still rejected).

@pranav-nvidia pranav-nvidia changed the title [None][feat] Serve MiniMax-M3.1-Flash with its bundled DSpark drafter [TRTLLM-17389][feat] Serve MiniMax-M3.1-Flash with its bundled DSpark drafter Oct 28, 2026
…check from lowerings

GQA DSpark keeps the DFlash resolution when the config declares a causal
window; the TRTLLM runtime check reads the returned lowerings, so windowed
layers skip the context-kernel head-size limit. MXFP8 scales are read as
UE8M0 bytes, a quantized draft config is refused, the drafter tests carry
cpu_only, and the 131k-prompt limitation is in the supported-models footnote.

Include the required draft length.

The shown configuration fails with DSpark max_draft_len must be > 0. Add max_draft_len: 7 for this checkpoint; its configured block size is 7 and the validator requires the values to match. (raw.githubusercontent.com)

Honor causal metadata for use_swa windows.

If a non-DFlash2 config declares is_causal=True or sliding_window_non_causal=False and specifies its window only through dflash_config.use_swa, the base resolver returns non-causal. _resolve_block_attention then adds the finite window, so the draft attends future block tokens despite the metadata. Resolve causality against the effective window, and add this case to test_dspark_noncausal_window.py. (raw.githubusercontent.com)

Keep the CUDA tests eligible for GPU collection.

The module-level cpu_only marker also marks four CUDA-gated checkpoint and block-decode tests. The H100 stage selects not cpu_only, so it excludes those tests. The CPU stage collects them but skips them without CUDA. Mark only the CPU test functions, or separate the CUDA tests into a GPU-collected module. (raw.githubusercontent.com)

As per path instructions: “Check pytest markers against the intended execution stage and repository collection conventions.”

The configuration shown here fails during argument validation: max_draft_len defaults to None, and the DSpark validator raises DSpark max_draft_len must be > 0 before loading the checkpoint. Could you include max_draft_len: 7 in this example, matching this drafter's block size? This is required for this PR.

This module also contains four @needs_gpu tests, including checkpoint loading and test_dflash2_block_decode_matches_reference_oracle. Marking the whole module cpu_only excludes those tests from normal GPU CI, which selects not cpu_only; CPU CI then skips them because CUDA is unavailable. Could you mark only the CPU tests, or move the CUDA tests into a separate module, so the existing GPU regression coverage still runs? This is required for this PR.

Approving — the comments below are optional touch-ups, not blockers.

All six earlier threads are addressed on this head; replies are in the threads. Two notes at the PR level.

Test coverage is better than the generated QA section says. l0_cpu.yml:118 and l0_h100.yml:79 include the whole hw_agnostic directory, so test_minimax_dspark_draft.py and the updated test_dflash2_semantics.py already run pre-merge. The new pytestmark = pytest.mark.cpu_only on test_dflash2_semantics.py moves that whole file onto the CPU stage; the description does not mention it, and it is worth a line since it changes where those tests run.

CI evidence for the merge path is from the previous head. 2bd688e changed the lowering caller and the mask override after pipeline 66667. Please run the bot on the current head before merge so the B200 oracle test (test_dspark_noncausal_window.py) is green on the code that lands. Also note l0_b300.yml lists only test_dspark_v41.py, so the B300 stage did not run the new file; only the B200 run covers it.

The Gemma norm fold has one inline note on precision and comment accuracy. Nothing blocking.

This folds 1 + w into the bf16 weight for every norm, including q_norm / k_norm. The comment above says this is "the same fold the MiniMax-M3 target applies", but the target only folds the layer-boundary norms (_fold_gemma_boundary_norm_weights) and keeps q_norm / k_norm as use_gemma=True. Storing 1 + w in bf16 rounds the factor to 2^-7 resolution near 1.0, so any |w| below ~0.004 disappears; the HF reference forms (1 + w.float()) in fp32 and rounds once after the multiply.

The fold is unavoidable for the DFlash-owned hidden_norm (torch nn.RMSNorm) and for the stacked k_norm weights the fused decode reads ([modeling_dflash.py:1374](https://github.com/NVIDIA/TensorRT-LLM/pull/20922/files#diff-88013be4688669b1724cca02724aca3870b589b0b2466d7d914e0e8b22f261f4R1374) does not add 1). For the three backbone norms this PR builds itself (input_layernorm, post_attention_layernorm, norm), RMSNorm(use_gemma=True) would be lossless and the fused context-KV fold at [modeling_dflash.py:1353](https://github.com/NVIDIA/TensorRT-LLM/pull/20922/files#diff-88013be4688669b1724cca02724aca3870b589b0b2466d7d914e0e8b22f261f4R1353) already honors that flag. Not blocking: either make that split, or reword the comment so it states the deviation from the target rather than parity.
