Dev Engineer Review

This change adds KVCM2 sparse-attention support. It adds host-backed sparse pools, a Batch-owned cell arena, sparse resolve/fetch/write-back kernels, index conversion, and shared selection groups.

The new Batch API changes lifecycle, publication, and stream-ordering requirements. A new resolve must follow all fetchResolvedPages() calls that use the current miss list and cell mapping. Cross-stream consumers need an event. Callers must also migrate from removed page-storage snapshot, decode-state, sparse-promotion, and offload APIs.

Storage now separates cache tier from backing medium and accounts for host-backed sparse pools under a separate quota. Host-memory backing now uses target-based resizing and separate registration tracking. These changes affect allocation, NUMA placement, and quota behavior.

The objectives describe a KVCM2 core split without Python consumers, but the supplied change summary includes nanobind bindings, Python stubs, introspection wrappers, and package exports. DSA/DSv4 consumer coverage and arena-sizing coverage remain outside this change, according to the objectives. No current review findings or test results were supplied. Severity counts and test status are unavailable.

QA Engineer Review

The change adds a C++ generator test and updates C++ configuration, host-memory backing, host-memory, and NUMA tests. It removes a concurrency test for page-storage snapshot readers. The Python KVCM2 suite adds coverage for sparse resolution, fetch and flush behavior, index tables, batch publication, quota sizing, and selection sharing. It removes older deferred-offload and storage-snapshot cases.

The current CI lists include unittest/kv_cache_manager_v2_tests in l0_a10.yml, l0_b200.yml, l0_cpu.yml, and l0_h100.yml. test_host_numa_placement.py appears in l0_gb200_multi_gpus.yml; this is not the changed C++ NUMA test. No changed integration test-list files were reported. The supplied evidence does not identify the changed C++ unit-test targets as integration-list entries. DSA/DSv4 consumer and arena-sizing coverage remains outside this change. Test results were not supplied. Coverage verdict: needs follow-up.

Description

The KVCM2-only subset of the sparse-attention offload work, split out so the cache-manager core can be reviewed and CI'd without its Python consumers.

Sparse attention needs a small, per-request GPU working set of KV units chosen afresh each step, while the history it is chosen from lives in host memory. This adds:

  • A per-request cell arena owned by Batch. Each request reserves one lease; a lease's cells are addressed as lease * cellsPerLease + bufferSlotInPool[buffer] * cellsPerBuffer + slot / unitsPerPage, so every buffer of a layer mirrors the same entry index.
  • Host-backed sparse pools. Sparsity is a property of a pool, so a pool group's key gains it alongside the existing coalescing group and size. That lets the GPU tier host-back exactly the sparse pools without the life cycle having to be wholly sparse or wholly dense.
  • Resolve / fetch / write-back kernels. The resolve maintains residency (residentOrdinal, lruOrder) and emits a selection-level miss list; the unit copy applies it per buffer; the flush writes back and only ever reads residency.
  • Selection groups. Layers driven by one indexer name a shared selection_id and share one resident set, one recency order and one resolve, while keeping their own mirrored cells. Previously each such layer re-resolved an identical selection, costing a launch and entriesPerLayer of metadata per layer. fetchSparsePages is the fused form and rejects a layer whose selection is shared; resolveSparseSelection + fetchResolvedPages serve the shared case.

Supporting changes in the same tree: a StrongIndex/TypedVec/EnumMap family for index type-safety that also works in device code, a named-buffer table for the Batch staging block, and a parallel initial host-tier fill built on this branch's target/step backing model.

Ordering contract worth a reviewer's attention: the miss list and per-slot cell mapping are one per life cycle, so the next resolve of any selection must be ordered after every fetchResolvedPages() consuming the current one — with an event where the consumer is on another stream.

Test Coverage

C++ unit tests in cpp/tests/unit_tests/batch_manager/ (plus one multi-GPU NUMA test):

  • kvCacheManagerV2ConfigTest — sparse cache config validation, including selection_id agreement, "silence is never shared", and same-life-cycle membership.
  • kvCacheManagerV2HostMemTest, kvCacheManagerV2HostMemBackingTest — host tier reservation/commit/registration, the parallel initial fill and its failure paths.
  • kvCacheManagerV2HostMemNumaTest (multi-GPU) — NUMA binding of the fill.
  • kvCacheManagerV2ColdPageTest, coldPageCodecTest, kvCacheManagerV2DefaultColdPageCodecTest — cold-page codec round-trips.
  • kvCacheManagerV2GeneratorTest — new, covers the coroutine generator utility the arena layout uses.
  • kvCacheManagerV2TypedIndexTest — StrongIndex/EnumMap layout invariants across every integral type.
  • kvCacheManagerV2ConcurrencyTest, kvCacheManagerV2SlotAllocatorTest, kvCacheManagerV2StatsTest, kvCacheManagerV2StagingBufferTest, kvCacheManagerV2ReentrantSharedMutexTest, kvCacheManagerV2DigestPoolTest.

Python-level coverage of this core (sparse selection sharing, arena sizing, the DSA/DSv4 consumers) rides on the companion full branch and is not part of this PR.

Walkthrough

This pull request adds sparse KV-cache configuration and kernels, host-backed pool accounting, and a redesigned Batch API for row management, index conversion, publication, and sparse operations. It also revises host-memory backing and adds a coroutine generator utility.

Changes

Sparse KV-cache and Batch integration

Layer / File(s) Summary
Sparse configuration and lifecycle shape
cpp/tensorrt_llm/batch_manager/kv_cache_manager_v2/config.*, kvCacheManager.*, lifeCycleRegistry.*, common.h, storage/*
Configuration and manager metadata define sparse selection layouts, per-layer cache settings, selection groups, and index-table specifications. Storage separates sparse and dense pools and supports an optional host sparse-pool quota alongside GPU allocation sizing.
Host-memory backing and pool accounting
cpp/tensorrt_llm/batch_manager/kv_cache_manager_v2/utils/hostMem*, storage/*, storageManager.*
Host backing reserves address space at construction and resizes a committed prefix toward a target. Pool accounting distinguishes cache tier from backing medium and accounts for GPU and host-backed sparse pools separately.
Cache lifecycle, sparse kernels, and Batch integration
cpp/tensorrt_llm/batch_manager/kv_cache_manager_v2/batch.*, kvCache.*, page.*, sparseCache*, indexConversionKernels.*
Batch owns fixed rows, sparse leases, staging, and converted index tables. Sparse kernels resolve selections, manage LRU residency, copy units, create flush lists, and convert page indices. KvCache adds Batch membership and sparse-lease handling, while page locks target the hot level.
Python API, introspection, and validation
cpp/tensorrt_llm/nanobind/batch_manager/kvCacheManagerV2.cpp, tensorrt_llm/runtime/kv_cache_manager_v2/*, tests/unittest/kv_cache_manager_v2_tests/*, cpp/tests/unit_tests/batch_manager/*
Bindings and type declarations expose sparse configuration, Batch operations, and introspection. Tests cover sparse sizing, index tables, membership, publication, sparse fetch and flush, and host-memory resizing. Design documents describe sparse attention and index conversion.

Critical · DeferredParallelFillKeepsEarlyWrites and… · kvCacheManagerV2HostMemTest.cpp:407-467

cpp/tests/unit_tests/batch_manager/kvCacheManagerV2HostMemTest.cpp:407-467
🎯 Functional Correctness | 🔴 Critical | ⚡ Quick win

DeferredParallelFillKeepsEarlyWrites and ParallelInitialFillThenGrow read constants that HostMem no longer has, so the test target will not compile.

This PR removed HostMem::kFillChunkSize and HostMem::kAlignment from hostMem.h. Its public sizing API is now only HostMem::sizeGranularity(). These two unchanged tests still use both constants: constexpr size_t kChunk = HostMem::kFillChunkSize;, plus the pattern strides and offsets based on HostMem::kAlignment.

The earlier tests in this file were migrated, but these two were missed. Replace the constants as follows:

  • HostMem::kAlignment → HostMem::sizeGranularity()
  • the fill chunk → HostMemBacking::commitChunkSize()

Two more adjustments are needed:

  • constexpr: sizeGranularity() is not constexpr, so kChunk, kSize, kInitial and kGrown become size_t const.
  • ParallelInitialFillThenGrow: its sizes must stay multiples of sizeGranularity(). kChunk / 4 is 8 MiB, so the test still holds with a 32 MiB chunk and a 2 MiB granularity.
🐛 Proposed fix
-    constexpr size_t kChunk = HostMem::kFillChunkSize;
-    constexpr size_t kSize = 4 * kChunk;
+    size_t const kChunk = HostMemBacking::commitChunkSize();
+    size_t const kSize = 4 * kChunk;
+    size_t const kUnit = HostMem::sizeGranularity();
 ...
-        = [](size_t offset) { return static_cast<unsigned char>((offset / HostMem::kAlignment) * 5 + 3); };
+        = [kUnit](size_t offset) { return static_cast<unsigned char>((offset / kUnit) * 5 + 3); };

Apply the same substitution to every HostMem::kAlignment and HostMem::kFillChunkSize use in ParallelInitialFillThenGrow.

cpp/tests/unit_tests/batch_manager/kvCacheManagerV2HostMemBackingTest.cpp:186-205
🎯 Functional Correctness | 🔴 Critical | ⚡ Quick win

CommitOfPopulatedRangeKeepsContents uses removed APIs, so the test target will not compile.

This PR migrated every other test in this file to the new API, but this one was missed. It still calls mBacking->reserve(mTotalSize) and mBacking->commit(chunk * mChunkSize, mChunkSize, /*populated=*/true), and it still reads kCommitUnit.

  • HostMemBacking no longer has reserve() or commit(). The new header has only the constructor that takes vmSize, plus setTargetSize(), resizeStep(bool populated) and resizeTo().
  • kCommitUnit is not defined anywhere in this file. The fixture defines only kUnitsPerChunk and kNumChunks.

Until this is fixed, this gtest binary fails to build, and CI fails with it. One option is to rewrite the test to open and populate the range up front, then step it with populated=true. The test should also check registration at register-unit granularity instead of kCommitUnit.

🐛 Proposed rewrite against the new API
-    MemAddress const base = mBacking->reserve(mTotalSize);
+    MemAddress const base = mBacking->address();
     ASSERT_NE(base, 0U);

     mBacking->open(0, mTotalSize);
     mBacking->populate(0, mTotalSize);
     stamp(base, 0, mTotalSize, 3);
-    for (size_t chunk = 0; chunk < kNumChunks; ++chunk)

-        mBacking->commit(chunk * mChunkSize, mChunkSize, /*populated=*/true);

and committed sizes match. Check registration at `commitGranularity()` intervals

The flushSparseUnits() contract describes a per-row bound that the code does not apply.

This comment says a move wider than the in-flight headroom is refused because "the per-row flush list is sized for one". The implementation applies a different check. Batch::flushSparseUnits adds up toUnit - fromUnit over all rows and compares that total with mScratch[lcId].flushWork.capacity. That capacity comes from maxTotalInputTokens, and the list is compacted. One prefilling row may cross many units while the other rows cross none. The constructor documentation and SPARSE_ATTENTION_DESIGN.md ("How much a step may cross") describe the aggregate bound correctly. A caller that reads this comment will assume a limit that does not exist.

Fixed. The contract now says what the code checks: crossings are summed over rows and compared against one compacted list per layer, sized from maxTotalInputTokens, so a prefilling row may use what decoding rows leave unspent. There is no per-row bound.

Skip zero-size sparse buffers in both sparse walks.

validate() skips layout validation for zero-size sparse buffers, and createStorageConfig() does not remove them. _computeSparseCacheShape() counts them, while _sparseBufferPlan() passes them to sparseLayout(), which rejects size == 0. This makes the shape and plan inconsistent and can fail sparse setup.

Fixed, and it was a real inconsistency: validate() already skipped sparseLayout() for a zero-size sparse buffer, but _computeSparseCacheShape() counted it and _sparseBufferPlan() passed it to sparseLayout(), which rejects a zero size. Both walks now skip it on the same terms validate() uses.

5. **The host page is authoritative once the watermark passes the block.** A block is
flushed to its host page by the `resize()` that raises `history_length` past it, after
which its cache entry is evictable. Before that it holds the only copy and is pinned.

Two sections still describe the old flush inside resize().

  • Lines 92-94 say a block is "flushed to its host page by the resize() that raises history_length past it".
  • Lines 217-222 say "The flush at resize() covers exactly [old_history, new_history)".

The "Who flushes" section of this document says the flush moved to Batch::flushSparseUnits(), and resize() now only checks the flushed history. "Arriving with a history" also clamps the range to [old_history, min(new_history, old_capacity)). The unclamped range at line 219 contradicts that clamp. A resumed request shows the difference: it flushes nothing, but the unclamped formula implies it flushes the whole prompt. Correct both statements so the design document gives one account of the flush.

Also applies to: 217-222

Release the GIL around peek_hit_miss_counter.

When counters exist, Batch::peekHitMissCounter() copies device data and calls cuStreamSynchronize() while the binding holds the GIL. This can block other Python threads. The constructor's manager queries do not establish an API-lock deadlock path.

Good catch — fixed on the branch this PR is split from, so it arrives with the next update rather than being visible here yet. The binding drops the GIL for peekHitMissCounter(), which copies device counters and synchronises, and takes it back for make_tuple.

The docstrings disagree with the declared return type about the "no batch" value.

  • The _KVCache.batch_row docstring says the property returns -1 when the cache belongs to no batch. The declared return type is BatchRow | None.
  • Batch.row_of (Line 1170-1171) has the same conflict: its docstring says "Row of a member, or -1".
  • The new tests treat None as the value for "no row". For example, test_a_seated_member_cannot_suspend asserts cache.batch_row == None, and every cleanup path checks batch.row_of(cache) is not None.

A caller who follows the docstring and checks row == -1 will never see that value. The caller then treats a non-member as seated. Change both docstrings to say None.

The prepare_sparse_write_indices Args section documents a parameter that does not exist and the wrong lease lifecycle.

  • The method has no batch parameter, but the Args section describes one.
  • The text says the reservation is "taken at :meth:_KVCache.resume". _KVCache.resume (Line 817-818) and Batch.add_kv_cache (Line 1063) say the opposite: resume takes no arena lease, and seating in the batch takes it.
  • fetch_sparse_pages (Line 1425) repeats the same claim: "Reservation at :meth:_KVCache.resume guarantees room".

A caller who follows these docstrings may resume a cache and expect write indices before seating it. That caller gets BAD_PAGE_INDEX for every row. Remove the batch entry, and change both places to say that Batch.add_kv_cache takes the lease.

Already addressed — the API documentation was refreshed for row-owned leases, so there is no batch parameter documented and no claim that the reservation is taken at _KVCache.resume. The stub now says the Batch's published rows own the leases and a seated cache uses its row's.

test_a_layer_may_mix_sparse_and_dense_buffers never builds a manager.

  • The docstring says sparsity "picks a buffer's pool and nothing above it".
  • The test only builds a KVCacheManagerConfig and reads back the is_sparse flags.
  • No KVCacheManager is constructed, so pool grouping and storage are never exercised.
  • The test therefore passes even if storage rejects a layer that mixes sparse and dense buffers.

Construct the manager. Then assert that one pool reports CacheTier.HOST_MEM and the other reports CacheTier.GPU_MEM.

Fixed. The test now builds the manager rather than only reading the flags back off a config — the pool grouping that has to tolerate the mix runs during construction, so the config-only form would have passed even if storage refused it.

test_scratch_staging_covers_the_layer_taking_the_most_sub_pages never shuts down its manager.

  • The finally block closes the cache but never calls manager.shutdown(). Every other test in this file does.
  • The manager therefore leaks its GPU and host pools into the following tests.
  • remove_kv_cache also runs whenever both objects exist, even if add_kv_cache failed. In that case it raises from finally and hides the original failure.

Remove the cache only while it is seated. Always shut down the manager.

The assertRaises block also covers add_kv_cache, so the test does not prove that publish() enforces the claim.

  • The docstring says the batch accepts the member and publish() refuses it.
  • add_kv_cache is inside the assertRaises block. If add_kv_cache starts to reject the member with a message that contains "SHARED life cycle", the test still passes.
  • The contract the test names, enforcement at publish(), then goes unchecked.

Seat the member outside the block, and assert that it was seated.

Validate both dimensions of pool selectors.

When grains_for_slots receives slot_size_list=[64] and pools=[1], typedPoolSelectors accepts the index. grainsForSlots then reads past the list through unchecked TypedVec::operator[]. A short second_pools list similarly leaves ratio_to_slot_count_list indexing a missing group. Either input can crash the Python process. Check the selector group count and each pool index against sizes before forwarding them. (raw.githubusercontent.com)

Preserve a fail-fast path for sparse offload.

If _sparse_layer_group_ids is non-empty and a request has a sparse page at HOST or DISK, sparse_metadata_batch remains unset and the non-GPU page check is skipped. copy_batch_block_offsets() then continues into dense offset copying, although dense offsets cannot address host sparse slots. This can produce invalid sparse reads.

Keep the Batch for configurations that can schedule sparse pages, or reject those configurations before offset copying. Add a regression test with one non-GPU sparse page in the KVCM2 manager test suite.

This is a deliberate work-around to confine this PR to the KVCM2 core.

Sparsity is not enabled here: nothing in this PR constructs the Batch that publishes sparse metadata, and every use of sparse_metadata_batch is guarded on it being set, so the paths it feeds stay inert. No sparse-offload test runs in CI against this branch either.

The next PR carries the rest of the feature — the fetch path that owns this Batch. It restores the construction, which removes this gap, and enables the sparsity tests at the same time.

Align the resume stub with the binding's is_decoding slot.

The binding keeps is_decoding as the second positional parameter, as the base revision did, so the binding's argument order did not change. The stub is the part that is out of sync. It declares optional_reuse_groups as the second positional parameter and omits is_decoding. A positional call that follows the stub, such as resume(stream, [group_id]), sends the list to is_decoding, which the binding declares as std::optional<bool>. Keyword calls that pass is_decoding=True do not match the stub's signature.

Restore is_decoding in the stub at the position the binding uses. Keep the binding unchanged.

Fixed, and the diagnosis was right: the binding keeps is_decoding as the second positional parameter while callers still pass it, and the stub was the side out of sync. The stub now declares it in that position and records that it is accepted and ignored.

When moving a member with live SWA scratch slots, this code moves the raw page-table row and rebinds mBasePageIndices, but leaves the scratch-slot staging and its binding at the source row. _stageScratch() subsequently publishes the member’s scratch range at the destination, where the slot IDs may still be stale or BAD_PAGE_INDEX.

Good catch — fixed. The scratch row is now swapped alongside the staging row and rebound to the destination in the same loop that rebinds mBasePageIndices, so the slots travel with the member the way its page indices already did. This matches addKvCache/removeKvCache, which bind and clear both tables together; move() was the only one of the three handling just one.

Added: addKvCache() now throws when the member's manager is not this Batch's. Rows, arena leases and index tables all belong to this manager, so such a member would be addressed through them and read memory that was never its own.

std::vector<int32_t> out(arena.numEntries());
cuCheck(cuMemcpyDtoHAsync(out.data(),

Good catch. This is actually a introspection API that is assumed to be called when user has synchronized. But I agree for such introspection APIs, it probably a good idea to add an explicit device sync before doing the operations.

…d Batch

The KVCM2-only subset of the sparse-attention offload work, split out so the
cache-manager core can be reviewed and CI'd without its Python consumers.

Sparse attention needs a small, per-request GPU working set of KV units chosen
afresh each step, while the history it is chosen from lives in host memory.
This adds:

- A per-request cell arena owned by `Batch`. Each request reserves one lease,
  and every buffer of a layer mirrors the same entry index.
- Host-backed sparse pools. Sparsity is a property of a pool, so a pool group's
  key carries it alongside the coalescing group and size; the GPU tier can then
  host-back exactly the sparse pools without the life cycle having to be wholly
  one or the other.
- Resolve, fetch and write-back kernels. The resolve maintains residency and
  emits a selection-level miss list; the copy applies it per buffer; the flush
  only ever reads residency.
- Selection groups: layers driven by one indexer share a resident set, a
  recency order and one resolve, while keeping their own mirrored cells.
  `fetchSparsePages` is the fused form and rejects a layer whose selection is
  shared; `resolveSparseSelection` + `fetchResolvedPages` serve that case.

Supporting changes in the same tree: a `StrongIndex`/`TypedVec`/`EnumMap` family
for index type-safety that also works in device code, a named-buffer table for
the `Batch` staging block, and a parallel initial host-tier fill built on this
branch's target/step backing model.

Ordering contract worth a reviewer's attention: the miss list and per-slot cell
mapping are one per life cycle, so the next resolve of any selection must be
ordered after every `fetchResolvedPages()` consuming the current one -- with an
event where the consumer is on another stream.

…d it

KvCache reports a life cycle's scratch range and its slots separately, through
getSwaScratchRange() and getScratchSlots(). Consumers in this tree still expect
the single object the manager used to return, so the binding layer pairs the two
accessors back into a ScratchDesc with `range` and `slot_ids`.

This lives only in nanobind: the core keeps the two accessors as its API. It is a
work-around that lets the KVCM2 core change stand alone, and should be removed
once the full sparse attention support is merged and its consumers read the two
accessors directly.

…till ask

KvCache no longer marks a decode transition. What enter_decode() did beyond
setting that flag was offload sparse history, and the sparse fetch path owns
that now; a cache with no sparse life cycle had nothing to offload, so an active
request was always admitted. The binding keeps answering that question so the
callers in this tree work unchanged.

Like the ScratchDesc pairing, this lives only in nanobind and is a work-around
that lets the KVCM2 core change stand alone. Remove it once the full sparse
attention support is merged and its callers stop asking.

Signed-off-by: Yao Yao <lowsfer@users.noreply.github.com>
The manager built a Batch to publish sparse page-storage metadata through. That
Batch is now the sparse fetch path's, built where the fetch happens, and its
constructor takes what the fetch needs rather than what the manager had.

Every use of `sparse_metadata_batch` is already guarded on it being set, so not
building it leaves those paths inert and the rest of the manager unchanged.

Like the two binding shims, this is a work-around that lets the KVCM2 core change
stand alone. Restore the construction once the full sparse attention support is
merged and brings the fetch path with it.

Signed-off-by: Yao Yao <lowsfer@users.noreply.github.com>
… pass it

Resuming no longer distinguishes a decoding request. What that selected was
sparse history offload, which the sparse fetch path owns now, so the parameter
has nothing left to choose and the binding accepts and ignores it.

Like the other binding shims, this is a work-around that lets the KVCM2 core
change stand alone. Drop the parameter once the full sparse attention support is
merged and its callers stop passing it.

The binding keeps `is_decoding` as resume()'s second positional parameter while
callers still pass it, but the stub declared `optional_reuse_groups` there and
omitted it. A positional call written against the stub sent its reuse-group list
to `is_decoding`, and a keyword call passing `is_decoding` did not match the
stub at all.

Goes with the binding shim it describes.
