PR description

Fixes #298.

Corrects attention-mask handling for unequal per-layer KV caches, addressing Transformers 5.x crashes while preserving causality during multi-token question processing.

  • Right-aligns causal masks with each layer’s cache length and safely extends ordinary causal masks for longer caches.
  • Wraps model-specific eager attention functions and passes dropout by keyword.
  • Preserves broadcast and two-dimensional padding masks. Restricted masks require a layer-specific mask when extending.
  • Adds regression coverage for pipeline generation, model.generate, and batched-versus-token-by-token decoding.

Validation

  • Latest CPU run on Transformers 5.2.0: all 94 relevant tests passed normally, including pipeline tests.
  • Earlier runs: all 94 relevant tests also passed on Transformers 4.57.6 and 5.0.0.
  • A broader offline run reached 220 passed and 115 skipped, then stopped with two failures and one setup error caused by unavailable external test assets.
  • Black, isort, flake8, mypy, copyright-header checks, and git diff --check pass.
  • Full make test validation remains incomplete. GPU testing was not performed.

Checklist

  • Tests are working (make test) — full-suite validation remains incomplete
  • Code is formatted correctly (make style, on errors try fix with make format) — equivalent checks passed as documented above
  • Copyright header is included
  • All commits are signed-off using git commit -s — correct the placeholder author/sign-off email before checking

The following items are N/A: this PR does not add a new press.

Summary by CodeRabbit

  • Bug Fixes
    • Improved attention handling for uneven cache lengths and causal masks.
    • Preserved valid padding and broadcast masks while rejecting unsupported mask configurations.
    • Ensured attention wrappers retain metadata and use a default dropout of zero.
    • Improved generation consistency across compressed caches, batched inputs, and sequential decoding.
  • Tests
    • Added coverage for attention-mask alignment, supported model behavior, cache compression, and multi-question generation.

Walkthrough

The attention patch now aligns four-dimensional masks with each layer’s key-cache length. It extends supported causal masks and rejects unsupported extensions. New tests cover backend behavior, compressed-cache generation, and decoding equivalence.

Changes

Cache Attention Alignment

Layer / File(s) Summary
Mask alignment and validation
kvpress/attention_patch.py, tests/test_attention_patch.py
The wrapper adjusts masks to each layer’s key-cache length. It extends valid unpadded causal masks, rejects unsupported extensions, and leaves eligible masks unchanged.
Backend registration and model coverage
kvpress/attention_patch.py, tests/test_attention_patch.py
Registration covers Transformers’ attention backends and supported models’ eager attention functions. Tests check model-specific attention behavior, including scaling and soft-capping.
Generation with uneven caches
tests/test_uneven_cache.py
Tests cover pipeline and standard generation with multiple cache-compression strategies. They also compare multi-token decoding with token-by-token decoding.

Explanation

The PR addresses issue #298. kvpress/attention_patch.py trims four-dimensional masks to each layer cache, extends only validated unpadded causal masks, and rejects unsupported restricted-mask extensions. It patches registered attention backends and supported model eager functions. The added tests cover SDPA, eager attention, pipeline question processing, generate, unequal cache directions, and batched versus token-by-token causality.

Full details: Out of Scope Changes check

Explanation

The changes stay within issue #298. The attention wrapper changes support the required backend and model-specific behavior. The new tests validate mask semantics and the reported uneven-cache paths. No unrelated production behavior or unrelated test area is introduced.

Create a standard causal mask based on the attention implementation used (stored in the config).
Default to `False`.

allow_torch_fix (`bool`, optional):

Deprecated and has no effect. Will be removed in version 5.18.0.

use_vmap (`bool`, optional):

Whether to use `vmap` during the mask construction or not. Allows powerful custom patterns that may not be

index-based (for the cost of speed performance). By default `False`.

device (`torch.device` or `str`, optional):

An optional device to create the mask on.

## Creating a simple causal mask:

To create the following causal mask:

0 ■ ⬚ ⬚ ⬚ ⬚

1 ■ ■ ⬚ ⬚ ⬚

2 ■ ■ ■ ⬚ ⬚

3 ■ ■ ■ ■ ⬚

4 ■ ■ ■ ■ ■

You can do

```python
>>> sdpa_mask(batch_size=1, q_length=5, kv_length=5)
>>> tensor([[[[ True, False, False, False, False],
[ True, True, False, False, False],
[ True, True, True, False, False],
[ True, True, True, True, False],
[ True, True, True, True, True]]]])
```

## Creating a sliding window mask:

To create the following sliding window mask (`sliding_window=3`):

0 ■ ⬚ ⬚ ⬚ ⬚

1 ■ ■ ⬚ ⬚ ⬚

2 ■ ■ ■ ⬚ ⬚

3 ⬚ ■ ■ ■ ⬚

4 ⬚ ⬚ ■ ■ ■

You can do

```python
>>> sdpa_mask(batch_size=1, q_length=5, kv_length=5, mask_function=sliding_window_causal_mask_function(3))
>>> tensor([[[[ True, False, False, False, False],
[ True, True, False, False, False],
[ True, True, True, False, False],
[False, True, True, True, False],
[False, False, True, True, True]]]])
```

## Creating a chunked attention mask

To create the following chunked attention mask (`chunk_size=3`):

0 ■ ⬚ ⬚ ⬚ ⬚

1 ■ ■ ⬚ ⬚ ⬚

2 ■ ■ ■ ⬚ ⬚

3 ⬚ ⬚ ⬚ ■ ⬚

4 ⬚ ⬚ ⬚ ■ ■

You can do

```python
>>> sdpa_mask(batch_size=1, q_length=5, kv_length=5, mask_function=chunked_causal_mask_function(3, torch.zeros(1, dtype=int)))
>>> tensor([[[[ True, False, False, False, False],
[ True, True, False, False, False],
[ True, True, True, False, False],
<excerpt>citeturn0search1 [wordlim: 200] Crawled: last week; Build attention masks with the `create_*_mask` functions in transformers.masking_utils. ...     from transformers.masking_utils import create_causal_mask ... A 4D mask has the shape `(batch_size, 1, query_length, kv_length)`, where `1` broadcasts the same mask across every attention head.
Use the `create_*_mask` functions instead.
Call [`create_causal_mask`] inside a decoder forward pass. Pass the config, the input embeddings, the user-provided 2D `attention_mask`, and the cache. The function uses the embeddings to read the batch size, query length, dtype, and device, and uses the cache to compute the key length.
    from transformers.masking_utils import create_causal_mask
    attention_mask = create_causal_mask(
        config=self.config,
        inputs_embeds=inputs_embeds,
        attention_mask=attention_mask,
        past_key_values=past_key_values,
    )
Call [`create_bidirectional_mask`] for encoder self-attention. Drop `past_key_values` because encoders don't cache.
    from transformers.masking_utils import create_bidirectional_mask
    attention_mask = create_bidirectional_mask(
        config=self.config,
        inputs_embeds=embedding_output,
        attention_mask=attention_mask,
    )
For cross-attention, pass the encoder states as `encoder_hidden_states` so the mask uses the encoder's key and value length instead of the decoder's query length.
Reject restricted 4D masks for non-suffix compressed caches.
PyramidKVPress and PerLayerCompressionPress can retain non-suffix entries, but this branch assigns attention_mask[..., -key.shape[-2]:] by compressed-cache index. Transformers builds a position-dependent 4D mask from padded 2D attention_mask values and shares it across layers. A retained padded entry can therefore receive the mask value for a different original token and become visible, changing the attention result.
The cache does not retain original positions. Validate the mask as unpadded causal before trimming, or reject it with the existing layer-specific-mask error.
Suggested fix
             difference = key.shape[-2] - attention_mask.shape[-1]
             if difference < 0:
+                _pad_causal_attention_mask(attention_mask, query.shape[-2], 0)
                 attention_mask = attention_mask[..., -key.shape[-2] :]
Update the difference < 0 branch in the attention-mask handling to validate that
the 4D mask is an unpadded causal mask by calling _pad_causal_attention_mask
before trimming it to key.shape[-2]; preserve the existing trimming behavior
only after validation, and retain the sliding-window rejection for longer
caches.
